Strong Teacher Not Needed? On Distillation in LLM Pretraining

This paper challenges the conventional assumption that knowledge distillation requires a stronger teacher to produce better students. Through systematic variation of architecture sizes and training token budgets, the authors find that even small, undertrained teachers can improve larger student models when language modeling and distillation losses are properly mixed. Counterintuitively, stronger teachers can saturate or reverse distillation gains, and distillation benefits generalization more than in-domain fitting.

Analysis of on-policy distillation reveals sparse, geometrically structured parameter updates

A new arXiv paper analyzes on-policy distillation (OPD) — a post-training method combining on-policy student trajectories with dense teacher supervision — across language and vision-language model pairs. The authors find that OPD updates are coordinate-sparse and distributed across layers (FFN-heavy), and that training only the discovered sparse subnetwork recovers near-full performance. Geometrically, updates are numerically full-rank but spectrally concentrated, falling disproportionately on near-zero weight coordinates, suggesting OPD retains distinct geometric signatures rather than behaving like ordinary dense parameter rewriting.

Systematic study reveals effectiveness-fluency trade-offs in LLM conditioning methods

A new arXiv paper systematically evaluates a range of LLM conditioning methods across both concept injection and removal scenarios, finding that efficient steering methods often degrade fluency significantly. A key finding is that activation steering is substantially less effective on instruction-tuned models than on base models, a previously overlooked interaction. Simple prompting and supervised fine-tuning work for concept injection but not removal, and cheap textual metrics are found to correlate well with expensive LLM-as-judge evaluations.

Distilling Tabular Foundation Models for Structured Health Data

This paper investigates knowledge distillation from tabular foundation models (TFMs) to lightweight student models for healthcare applications. The authors address context leakage in in-context TFMs via stratified out-of-fold teacher labeling, evaluating across 19 healthcare datasets, 6 TFM teachers, and 4 student families. Distilled students retain at least 90% of teacher AUC while running 26× faster on CPU, with preserved calibration and fairness properties. Multi-teacher ensembles do not consistently outperform the best single teacher.

Canonical-Context On-Policy Distillation (CCOPD) for Multi-Turn LLM Consistency

This paper identifies 'self-anchored drift' as a key failure mode in multi-turn LLMs: when information is revealed incrementally across turns, models produce unsupported assumptions that distort final answers, even when the total evidence is identical to a single-prompt setting. The authors propose Canonical-Context On-Policy Distillation (CCOPD), which trains a student model on incremental multi-turn conversations to match the output distribution of a frozen teacher conditioned on the full clean prompt. Trained only on math conversations, CCOPD achieves a 32% average relative improvement on multi-turn (RAW-SHARDED) tasks and generalizes zero-shot to five out-of-domain task families while preserving single-prompt performance.

ZPPO: Teacher-in-prompt training method outperforms distillation and GRPO for small vision-language models

Researchers introduce Zone of Proximal Policy Optimization (ZPPO), a training method inspired by Vygotsky's zone of proximal development that embeds teacher guidance in prompts rather than policy gradients or logit imitation. On hard questions where student rollouts fail, ZPPO constructs Binary Candidate-included Questions (BCQ) and Negative Candidate-included Questions (NCQ) to help the student discriminate correct from incorrect responses, with a replay buffer that recirculates hard questions until mastered. Evaluated on the Qwen3 family (0.8B–9B) with a 27B teacher across a 31-benchmark suite covering VLM, LLM, and video tasks, ZPPO outperforms both distillation and GRPO baselines, with the largest gains at the smallest model scale. The method addresses a known failure mode of RL training where zero-reward rollouts produce no gradient signal.

ZEDA: Post-Trained MoE Models Can Skip Half Their Experts via Self-Distillation

This paper introduces Zero-Expert Self-Distillation Adaptation (ZEDA), a framework that converts static post-trained Mixture-of-Experts (MoE) language models into dynamic ones without pre-training from scratch. ZEDA injects parameter-free zero-output experts into each MoE layer and uses two-stage self-distillation with the original model as a frozen teacher. Applied to Qwen3-30B-A3B and GLM-4.7-Flash across 11 benchmarks, ZEDA eliminates over 50% of expert FLOPs with marginal accuracy loss and achieves approximately 1.20× end-to-end inference speedup, outperforming the strongest dynamic MoE baseline by 4–6 points.

HumP-KD: Uncertainty-aware multi-stage knowledge distillation for efficient fire classification

Researchers propose HumP-KD, a knowledge distillation framework that compresses two heterogeneous transformer teachers (Swin-Tiny and ViT-Base) into a lightweight MobileViT-S student for real-time fire classification. The student model achieves 0.9876 mean F1 on a 31K-image dataset while retaining only 4.94M parameters—a 5.7× reduction over Swin-Tiny—and runs at 37.72 CPU FPS. The framework combines hierarchical feature alignment, spatial attention masking, and progressive multi-stage distillation to maintain accuracy under degraded visual conditions.
